"Evaluating the Effectiveness of Clustering Analysis Tools for Predicting Traffic Patterns and Optimizing Highway Network Operations"
Abstract
The rapid growth in urbanization, population, and vehicle ownership has significantly increased traffic congestion, resulting in longer travel times, higher fuel consumption, increased accident risks, and adverse environmental impacts. Traditional traffic prediction methods often struggle to analyze the complex, dynamic, and high-dimensional nature of modern traffic data, creating a need for more advanced analytical techniques. Clustering analysis, an unsupervised machine learning approach, has emerged as a promising solution for identifying hidden traffic patterns, detecting congestion hotspots, and supporting intelligent highway management. This study evaluates the effectiveness of selected clustering analysis tools, including K-Means, Hierarchical Clustering, Density-Based Spatial Clustering of Applications with Noise , Gaussian Mixture Models , Fuzzy C-Means, and Spectral Clustering, in predicting traffic patterns and optimizing highway network operations. The research adopts a quantitative research design using traffic datasets obtained from intelligent transportation systems, highway sensors, GPS devices, and traffic monitoring stations. Data preprocessing techniques such as cleaning, normalization, and feature extraction are applied prior to clustering. The performance of the selected algorithms is evaluated using clustering quality indices, including the Silhouette Score, Davies–Bouldin Index, Calinski–Harabasz Index, Adjusted Rand Index , and Normalized Mutual Information , alongside prediction performance measures such as Accuracy, Precision, Recall, F1-Score, Mean Absolute Error , and Root Mean Square Error . The study further examines the computational efficiency, scalability, robustness to noise, and practical applicability of each clustering technique under varying traffic conditions. The findings are expected to identify the most effective clustering algorithms for traffic prediction, congestion detection, travel time estimation, and highway operational optimization. The study will provide valuable insights for transportation engineers, highway management agencies, policymakers, and researchers seeking to improve intelligent transportation systems through data-driven decision- making. Ultimately, the research contributes to the advancement of artificial intelligence applications in transportation by offering practical recommendations for enhancing traffic forecasting, reducing congestion, improving road safety, and promoting sustainable highway network operations.
